中文摘要: 无人机高空小目标识别在城市建设、军事侦察和航海监控等领域具有重要应用价值. 针对航拍图像目标微小、背景复杂及遮挡等难题, 本文提出APW-YOLOv8算法, 引入自适应空间相关性金字塔注意力机制ASCPA, 通过空间金字塔编码(SPE)提取多尺度空间信息, 并利用空间相关特征重标定模块(SCFM)实现浅层与深层特征的深度融合, 显著增强了模型对多尺度信息的感知能力. 此外, APW-YOLOv8在Neck部分新增P2小目标检测层, 通过拼接浅层与深层特征图, 进一步强化了小目标特征提取能力. 同时, 引入Inner-CIoU损失函数并结合尺度因子优化损失计算, 提升多尺度特征提取性能. 在VisDrone2019数据集上, APW-YOLOv8的mAP@0.5和mAP@0.5:0.95分别达到31.9%和18.8%, 较YOLOv8n提升3.7%和2.3%. 在超远距离遥感RSOD数据集上, mAP@0.5和mAP@0.5:0.95较YOLOv8n提升3.7%和2%. 实验结果表明, APW-YOLOv8有效解决了小目标漏检与误检问题, 为复杂空域检测提供了高效、实用的解决方案, 具有广阔应用前景.
Abstract:Unmanned aerial vehicle (UAV) high-altitude small target identification holds application significance in urban construction, military reconnaissance, and maritime surveillance. To address challenges such as tiny targets, complex backgrounds, and occlusions in aerial images, this study proposes the APW-YOLOv8 algorithm. The algorithm introduces an ASCPA mechanism, which utilizes SPE to extract multi-scale spatial information and employs SCFM to achieve deep fusion of shallow and deep features, significantly enhancing the model’s perception of multi-scale information. Additionally, APW-YOLOv8 incorporates a P2 small target detection layer in the Neck network, which concatenates shallow and deep feature maps to enhance the extraction ability of small target features. Furthermore, the Inner-CIoU loss function is introduced to optimize loss computation by combining the scale factor, thereby improving multi-scale feature extraction performance. On the VisDrone2019 dataset, mAP@0.5 and mAP@0.5:0.95 of APW-YOLOv8 reach 31.9% and 18.8% respectively, an improvement of 3.7% and 2.3% respectively over YOLOv8n. On the ultra-long-range remote sensing RSOD dataset, mAP@0.5 and mAP@0.5:0.9 of APW-YOLOv8 increase by 3.7% and 2% respectively compared to YOLOv8n. Experimental results demonstrate that APW-YOLOv8 effectively solves missed and false detections of small targets, providing an efficient and practical solution for complex airspace detection, with broad application prospects.
